This is a notable shift from the 2010s, where symbols were treated as anathema (Avoid at any cost). Indeed, multiple top figures (Andrew Ng, Sepp Hochreiter, J\u00fcrgen Schmidhuber) have recently voiced support for hybrid neuro-symbolic systems, considering them \u201cthe most promising approach\u201d to achieve more general and reliable AI.\n\nAmid these developments, neuro-symbolic AI (NeSy) has re-emerged as a crucial research direction. By fusing these elements, a neuro-symbolic system will have the ability to outperform either method on its own.\n\nA few examples of these increased capabilities include handling out-of-vocabulary inputs, learning from far smaller datasets, recovering from errors, and providing transparent reasoning in ways pure deep learning cannot.\n\nA neuro-symbolic architecture typically consists of at least two intertwined components:\n\u2022 One or more neural sub-systems (e.g., deep neural networks, transformers, or learned embeddings) to process perceptual inputs or unstructured data.\n\u2022 A symbolic reasoning layer (e.g., a knowledge base, logic engine, rule system, or program executor) that uses discrete symbols or expressions.\n\nThese two components work co-cohesively and exchange information with each other.\n\nFor instance, a neural network might perceive objects in an image and output symbolic tokens representing those objects, which a logical reasoner then uses to answer a query about the scene. Conversely, symbolic knowledge may constrain or guide the neural network, e.g., by regularizing its outputs to obey physical laws or by providing it with structured context (like ontologies or graph relations) that improve learning. Yet, early research showed it was possible to combine them. In fact, as early as 1943, researchers McCulloch and Pitts proposed neuron-like circuits capable of logical reasoning. During the 1990s and 2000s, some researchers explored neural networks combined with logic, but these efforts remained limited and specialized. Although symbolic methods became less popular during the deep-learning boom of the 2010s, renewed awareness of deep learning\u2019s limitations eventually sparked fresh interest in hybrid models. This resurgence led to what\u2019s known as the \u201cthird wave of AI,\u201d a term introduced by DARPA, emphasizing AI systems capable of contextual adaptation and reasoning. DARPA\u2019s \u201cAssured Neuro-Symbolic Learning\u201d program explicitly aims to develop \u201chybrid AI algorithms that integrate symbolic reasoning with data-driven learning to create robust, assured, and trustworthy systems\u201d.\n\nToday, neuro-symbolic AI includes a variety of techniques and models. These include explicit logic-integrated networks, such as Logical Neural Networks (LNNs), which incorporate learnable logical rules; neural theorem provers (NTPs) that perform differentiable logic inference over embeddings; and vector-symbolic architectures (VSA), which utilize high-dimensional vectors to encode symbols and enable algebraic manipulation of symbolic structures in a neural form.\n\nA notable example is Logic Tensor Networks (LTN) by Badreddine et al. (2021), a framework that grounds first-order logic formulas in a real-valued vector space using fuzzy logic semantics. In LTN, symbolic knowledge (logical rules) is compiled into differentiable constraints on a neural network\u2019s training objective, allowing the model to learn from data while respecting those rules. As the MIT-IBM Watson AI Lab describes, \u201cby fusing these two approaches, we\u2019re building a new class of AI far more powerful than the sum of its parts.\u201d Such hybrid systems require less training data, can explicitly track the steps of inference, transfer knowledge across tasks more easily, and are closer to learning the way humans do, by connecting percepts with symbols and mastering abstract concepts.\n\nSeveral converging factors make this hybrid paradigm especially relevant now.\n\nAs examined, even the most advanced large language models (LLMs) and deep neural networks, despite their impressive fluency and accuracy with familiar data, still falter on tasks that require multi-step logical reasoning, consistent memory, or reliable knowledge retrieval. High-profile evaluation failures, such as GPT -3\u2019sdifficulties with basic arithmetic and logic puzzles, demonstrate that simply scaling up these models does not solve certain core weaknesses.\n\nAnother critical issue is the problem of \u201challucination,\u201d where generative models produce responses that sound plausible but are factually incorrect. In high-stakes domains like medicine or finance, these hallucinations are not just quirks; they can pose significant risks. Purely neural systems also lack the ability to recognize when they do not know something or to enforce explicit constraints, such as making sure that units are balanced in a physics problem. This is because they lack an internal model of truth, logic, or factuality.\n\nThis is where symbolic reasoning provides a solution by introducing mechanisms for imposing logical consistency, factual correctness, and enforceable constraints on AI outputs. For example, a neuro-symbolic approach allows an LLM to generate a candidate answer, which is then verified by a logical interpreter or knowledge base before the final output is produced. This system of \u201cchecks and balances\u201d can identify contradictions and significantly reduce hallucinations by guaranteeing that the AI\u2019s outputs are grounded in and verifiable from a reliable knowledge source.\n\nIn summary, neuro-symbolic AI addresses the robustness and trustworthiness deficits of deep learning by injecting logical consistency, factual validation, and verifiability into the decision-making process.\n\nNeed for abstract reasoning and generalization.\n\nMany real-world problems require reasoning steps that go far beyond simple pattern matching. Tasks such as solving mathematical word problems, making causal inferences, or understanding new combinations of concepts require genuine logical reasoning. Large language models (LLMs) often require extensive prompt engineering or chain-of-thought prompting to attempt multi-step reasoning, and even then, their answers can still go astray. In contrast, neuro-symbolic methods have demonstrated stronger capabilities in compositional generalization, the ability to combine learned components to solve new, more complex problems.\n\nA recent Apple study introduced a symbolic benchmark called GSM-Symbolic, which is based on the GSM8K math dataset, to test these abilities. The researchers found that all tested LLMs exhibited weak reasoning. When they increased the number of clauses in a math question or simply shuffled the numbers, the models\u2019 accuracy dropped sharply. A household robot, for instance, must integrate visual perception with high-level planning. It should recognize objects (a neural task) but also follow logical steps to achieve goals (a symbolic planning task). Pure end-to-end learning struggles here due to the combinatorial explosion of states and the rarity of certain events in training.\n\nDigital twin simulations and symbolic world models are increasingly used to provide structure and organization. For example, a robot can maintain a symbolic representation of its environment (a map of objects, locations, and their relationships) that is updated by neural perception. Classical symbolic planning algorithms, such as PDDL planners, can be employed to determine a sequence of actions needed to achieve a goal.
